The Stepwise Informativeness Assumption: When Do Entropy Dynamics Track Reasoning Correctness in LLMs?
summary
The gist
The Stepwise Informativeness Assumption (SIA) provides a structural explanation for why internal entropy dynamics correlate robustly with external correctness in autoregressive reasoning models.
In short
The Stepwise Informativeness Assumption (SIA) explains why internal entropy dynamics correlate with external correctness in autoregressive models. The paper formalizes this by proposing that reasoning prefixes accumulate information about the true answer in expectation. Empirical validation shows that training induces a distribution satisfying SIA, and correct traces exhibit specific entropy signatures like early lock-in, distinguishing them from incorrect reasoning.
Key concepts
- Stepwise Informativeness Assumption (SIA)
- This assumption posits that reasoning prefixes in an autoregressive model accumulate information about the true answer in expectation. It suggests that conditional answer entropy acts as a progress variable, tracking the cumulative amount of answer-relevant information gained during the reasoning process. Successful reasoning chains are expected to show this entropy decreasing reliably.
- Conditional Answer Entropy
- This measure quantifies the uncertainty remaining about the true answer given a specific sequence of reasoning prefixes. It is calculated by looking at how much information is lost or gained when moving from a prefix to its subsequent state. Under SIA, this entropy should decrease along correct reasoning paths as more relevant information about the final answer is incorporated.
- SIA Alignment Coefficient (rhoSIA)
- This coefficient measures the correlation between the conditional answer entropy and gold surprisal (the inverse probability of a correct token) along each generated trace. A high positive alignment indicates that when uncertainty decreases, it happens in a way that aligns with the expected information gain from correct reasoning, serving as a metric for truth-directed entropy descent.

Recent work uses entropy-based signals at multiple representation levels to study reasoning in large language models, but the field remains largely empirical. From a theoretical perspective, reductions in model uncertainty do not necessarily reflect progress toward correctness. In this work, we characterize when such alignment can be expected through the Stepwise Informativeness Assumption (SIA), which requires entropy-reducing reasoning-prefix extensions increase the probability assigned to valid answers in expectation. We show that next-token prediction can transfer answer-relevant information from training data to the model, but does not, by itself, guarantee alignment with correctness. Instead, we propose that this alignment depends on how the training regime couples reasoning traces to correct answers. Furthermore, we hypothesize observable signatures of this phenomenon and characterize its expected failure regimes. We empirically investigate how entropy dynamics relate to correctness across four reasoning benchmarks (GSM8K, ARC, SVAMP, MATH) and diverse open-weight language models spanning base, instruction-tuned, and RL-trained regimes. Our results show that entropy-correctness alignment strengthens with post-training but can weaken when task difficulty exceeds model capabilities.

Tom: We're looking at the paper: "The Stepwise Informativeness Assumption".
Jane: Here's the gist of the paper. The Stepwise Informativeness Assumption (SIA) provides a structural explanation for why internal entropy dynamics correlate robustly with external correctness in autoregressive reasoning models.
Tom: How it works The core argument posits that this correlation arises because autoregressive models learn to accumulate information about the true answer via answer-informative prefixes, a pattern inherited from human reasoning traces and reinforced by training pipelines The paper formalizes this intuition via the Stepwise Informativeness Assumption (SIA), which states that reasoning prefixes accumulate information about the true answer in expectation Under SIA, conditional answer entropy is interpreted as a progress variable for reasoning, tracking cumulative answer-relevant information and decreasing along successful reasoning chains This framework predicts that characteristic signatures of this descent indicate whether reasoning converges reliably to the correct answer Information-Theoretic Preliminaries The paper defines several information-theoretic measures to quantify uncertainty and information gain during reasoning Definition 6 defines Entropy as H(X):= − P x∈X p(x) log p(x) Definition 7 defines Conditional entropy as H(Y X):= − P x∈X,y∈Y p(x, y) log p(x,y) / p(x) Definition 8 defines Mutual Information as I(X; Y):= P x∈X,y∈Y p(x, y) log p(x,y) / (p(x)p(y)) Stepwise Informativeness Assumption (SIA) The SIA is formalized as a minimal information-theoretic condition stating that reasoning prefixes accumulate information about the true answer in expectation Proposition 1 shows that under a fixed joint p ∈ Π, conditional answer entropy is not merely an internal uncertainty measure but a progress variable tracking how much information about the true answer has been accumulated Assumption 1 (SIA) calls this the Stepwise Informativeness Assumption (SIA), constraining that prefixes contain information about the final answer in expectation Empirical Validation and Signatures The empirical validation tests whether training induces an answer-consistent distribution p ∈ Π that satisfies SIA and that pθ faithfully approximates it The paper defines the SIA alignment coefficient ρSIA as the correlation between conditional answer entropy and gold surprisal along each trace Results show that supervised fine-tuned models exhibit strong positive alignment, indicating that truth-directed entropy descent is a training-induced structural feature Observable signatures include early lock-in, where correct traces accumulate a larger fraction of their total answer-relevant information earlier in the generation Ablations and Robustness The paper tests whether observed dynamics reflect stepwise structure rather than superficial artifacts through shuffle-prefix ablation Table 2 shows that randomly permuting tokens within prefixes sharply degrades alignment, indicating that truth-directed entropy descent depends on structured accumulation rather than token count Monte-Carlo approximation tests confirm that SIA alignment is not an artifact of low-fidelity estimation The work establishes that SIA is the minimal structural condition under which entropy-based reasoning analyses are theoretically justified It demonstrates that standard training pipelines induce model behavior consistent with SIA, and correct reasoning traces exhibit characteristic entropy signatures that distinguish them from incorrect answers This provides a structural explanation for the observed correlation between internal entropy dynamics and external correctness in autoregressive models.

Tom: Page 1 --- The Stepwise Informativeness Assumption: Why are Entropy Dynamics and Reasoning Correlated in LLMs?
Title and authors: Tom: Okay, so we've established that this paper, "The Stepwise Informativeness Assumption: When Do Entropy Dynamics Track Reasoning Correctness in LLMs?", is proposing that the link between internal entropy and external correctness is structural >
Jane: It’s not just empirical observation anymore; they’re formalizing it through the Stepwise Informativeness Assumption, which essentially claims that reasoning prefixes accumulate answer-relevant information in expectation as generation progresses >
Lu: The paper shows this assumption naturally emerges from maximum likelihood optimization on human reasoning traces and how standard fine-tuning pipelines reinforce it >
Meng: So what’s the practical value there? Is this just academic theory, or does it help us build better training pipelines that produce more reliable models?
Lalam: It helps by giving us a way to measure if our models are actually learning the right things about the answer, instead of just guessing randomly >
Tom: Exactly. They derive a specific signature called the SIA alignment coefficient which correlates conditional answer entropy with gold surprisal along each generation trace >
Jane: And they find that supervised fine-tuned models show a strong positive correlation, meaning truth-directed entropy descent is actually a feature induced by the training process itself >
Lu: The key finding there is that this isn't just some random coincidence; it’s a structural property of how these models are trained on human reasoning traces >
Meng: If we can reliably measure this coefficient, we could potentially use it for early stopping methods, maybe telling the model when its uncertainty plateaus or drops below a certain threshold >
Lalam: That would be powerful because it moves us away from just guessing and toward a system that is actively tracking how much information it has gained about the target answer >
The paper's summary: Tom: Let's look at the actual mechanism they are proposing. They define entropy, conditional entropy, and mutual information to provide this framework for quantifying uncertainty during reasoning steps >
Jane: They say that by defining these measures this way, we can interpret conditional answer entropy as a progress variable—something that tracks cumulative answer-relevant information >
Lu: The Stepwise Informativeness Assumption formalizes that prefixes contain information about the final answer in expectation, which means as you go deeper into the generation, this uncertainty should systematically decrease along successful reasoning chains >
Meng: So, instead of just looking at the last token's probability, we can look at how that uncertainty level has evolved over all previous steps to gauge if it’s on the right path >
Lalam: It gives us a principled way to quantify that progression; it moves us beyond just measuring the final output quality and starts measuring the reasoning process itself >
Tom: They show this isn't just an internal uncertainty measure; under a fixed joint probability distribution, conditional answer entropy is interpreted as tracking how much information about the true answer has been accumulated >
Jane: So what does that mean for a listener who doesn't read these papers? It means we can treat the model’s uncertainty curve as a progress bar for solving the problem >
Lu: It suggests that characteristic signatures of this descent—the way entropy changes over time—can actually tell us whether reasoning is converging reliably to the correct answer >
Meng: If we can spot those specific patterns, it helps diagnose *why* a model is failing, not just that it failed >
The paper's improvements: Tom: The paper points out some things they want to improve or test beyond just observing this correlation. They focus on verifying if these dynamics are truly stepwise rather than some superficial artifact >
Jane: They introduce the shuffle-prefix ablation experiment, where they randomly permute tokens within prefixes to see if the alignment sharply degrades, which proves that it depends on structured accumulation >
Lu: And they use Monte Carlo approximation tests to confirm that this SIA alignment isn't just an artifact of low-fidelity estimation; it’s a real phenomenon >
Meng: From an engineering standpoint, this is huge because it means we don’t have to worry about some shortcut where token count might be misleading us; the structure of the input matters more than just how many tokens you feed in >
Lalam: They are showing that truth-directed entropy descent actually depends on structured accumulation rather than just token count, which is a pretty important distinction for building robust systems >
Tom: So they’re pushing for verification that this isn't some easy trick; it needs to be proven through ablation tests to show the stepwise structure holds up >
Jane: It’s about making sure that when we see those entropy signatures, we know they represent real progress and not just a random quirk of the model architecture >
Conclusion: Tom: So wrapping things up on this paper, "The Stepwise Informativeness Assumption: When Do Entropy Dynamics Track Reasoning Correctness in LLMs?", the main point is that SIA provides the minimal structural condition for entropy-based reasoning analyses to be theoretically sound >
Jane: It demonstrates that standard training pipelines naturally induce model behavior consistent with this assumption, and correct reasoning traces display specific entropy signatures that separate them from incorrect answers >
Lu: It’s a structural explanation for why we see internal entropy dynamics correlate robustly with external correctness in autoregressive models, which is really tying the mechanics to the outcomes >
Meng: For production teams, this means we have a stronger way to diagnose model behavior—if we see that characteristic entropy descent, you know you’re looking at a correct reasoning trace >
Lalam: It gives us a solid foundation for using these entropy analyses as tools to assess how well an AI is actually thinking through a problem, not just what its final output looks like >
Tom: That’s the gist of it. We have this framework now to explain the correlation between internal uncertainty and external correctness in autoregressive models thanks to the Stepwise Informativeness Assumption >
